Why “a Bigger Model” Is Sometimes the Wrong Shortcut

When an inference system doesn’t deliver the desired results - too slow, not accurate enough, or unstable - one of the automatic reactions is: “let’s make the model bigger.”

Sometimes that helps. But very often - it isn’t a diagnosis. It’s a mental shortcut.

The hidden assumption is simple: if the result isn’t good - there must not be enough compute.

But in real systems, the problem is usually not the computation itself - it’s the way it’s integrated into the system.

Inference Is Not Just a Model

It’s an entire flow:

data comes in → passes through the network → is handled by the CPU → is transferred to the accelerator → and comes back out.

If this flow isn’t coordinated - even a small model can run slowly, and a bigger model will only make things worse.

This is where the confusion between computation and transport arises.

A Bigger Model

  • Increases computation time
  • Increases memory consumption
  • And increases transport volume

But if the bottleneck is:

  • Data transfer
  • Queues
  • Request management
  • Or scheduling between components

Adding more computation doesn’t solve the problem - it just piles more load on top of it.

That’s why a small model can run slowly in a poorly tuned system.

Not because the model is “weak,” but because the system:

  • Doesn’t feed it at the right rate
  • Doesn’t batch requests efficiently
  • Or doesn’t utilize the hardware in real time

In such a case, making the model bigger is like replacing the engine of a car whose real problem is a traffic jam.

Systemic Optimization vs. Brute Force

Brute force says: if it doesn’t work - add more power.

Systemic optimization asks:

  • Where is time being wasted
  • Who is waiting for whom
  • And which component is actually the limiting one

The first is quick to decide. The second requires understanding.

But only one of them holds up over time.

An Analogy

Adding more employees to an office where the documents get stuck at the entrance.

There will be more workforce - but the problem will remain.

Summary

A bigger model is sometimes the right solution. But when it’s chosen without understanding the system - it’s a symptom of poor diagnosis, not depth.

A responsible system doesn’t ask “how do we make the model bigger?” but rather “where is the problem, really - and is compute even the missing piece?”

Because computing power can be bought. Coordination and understanding - have to be built.
